What is Feature Engineering

Feature Engineering (FE) is the process of creating, transforming, and selecting data attributes (or features) from raw data so that machine learning (ML) algorithms can learn patterns more effectively. Instead of relying on raw data, FE derives new features or refines existing ones to represent underlying patterns in the data that ML models need to learn.

Feature Engineering helps in building a good ML model that:

  • Improves model accuracy and predictive performance

  • Reduces noise and removes irrelevant information

  • Enables models to learn patterns more effectively

  • Decreases training time by reducing the number of unnecessary features

  • Makes model outputs easier to interpret

Feature Engineering versus Data Transformation

Although both Feature Engineering and Data Transformation modify data, they address different aspects of data preparation. While Data Transformation focuses on preparing data for processing and analysis, Feature Engineering focuses on creating and refining features that improve machine learning and analytical outcomes.

Consider an example of customer transaction dataset. Let us see what both processes do to the dataset:

  • Data transformation removes duplicate records, converts order date column to date type, joins customer and transaction tables, and filters inactive customers.

  • Feature engineering creates customer lifetime value, calculates average purchase frequency, and encodes membership type.

  Data Transformation Feature Engineering
Purpose Convert, clean, and reshape data to make it usable for analysis, reporting, or downstream processing. Create and prepare features that improve the performance of machine learning models.
Primary Focus Improving the quality, structure, and compatibility of the dataset. Improving the predictive value of the dataset.
Common Operations Filtering, joining, aggregating, sorting, type conversion, schema mapping, data cleansing, and column transformations. Encoding, scaling, feature creation, feature selection, imbalance handling, outlier handling, and imputation.
Typical Users Data engineers, ETL developers, and Analytics Engineers. Data scientists, ML engineers, and Data Engineers.
Output A transformed dataset ready for storage, reporting, integration, or further processing. A feature-rich dataset optimized for machine learning or advanced analytics.
Downstream Use Data warehouses, dashboards, BI reports, analytics, and as input to Feature Engineering. Model training, validation, inference, and AI applications.

Role of Feature Engineering in Machine Learning lifecycle

Feature Engineering is a data preparation stage in the machine learning (ML) lifecycle. It takes place after data collection and preprocessing and before model training. Its purpose is to transform raw or prepared data into meaningful features that improve the performance and accuracy of machine learning models. FE bridges the gap between prepared data and model training. During this stage, raw or transformed data is enhanced to create features that better represent the underlying patterns in the data, enabling machine learning models to learn more effectively.

Use Cases of Feature Engineering

Some typical use cases of feature engineering include:

  • In financial services like credit risk assessment or loan default prediction, instead of using account balance, you can create features such as:

    • Average monthly balance

    • Number of overdrafts in the last 6 months

  • In retail and E-commerce for product recommendations you can create features such as:

    • Total purchases in last 90 days

    • Days since last purchase

  • In healthcare for disease prediction, patient risk scoring, hospital readmission prediction. Instead of relying only on lab reports you can derive features like:

    • BMI

    • Average blood pressure over time

    • Medication adherence score.
